Which course should I pursue to become an astronaut, aerospace engineering or aeronautical engineering?
What is the difference between both the courses?

It's good to know that you want to become an astronaut. But unfortunately only one Indian national has become an astronaut till now. He was a fighter pilot in IAF.
Aerospace is the name of the industry that produces aeronautical products.
A lot of colleges offer aeronautical engineering. IIT's, NIT's and many others.
